This study comparatively analysed per capita gross domestic product (GDP), current health expenditure (CHE), CO2 emissions (CO2), PM2.5 air pollution (AP) and the urban population ratio (UPR) using linear regression (OLS) and Random Forest regression (RF) methods. Findings derived from the 2009–2020 dataset revealed significant differences in model performance. Examining the results of the linear regression model revealed that the explanatory power increased significantly (R² ≈ 0.97) when both the time effect and the country-specific dummy variables were included in the model. This indicates that structural differences between countries play a critical role in life expectancy. However, the Random Forest regression model demonstrated stronger predictive performance. Notably, the 1,000- tree model achieved the highest explanatory power (R² ≈ 0.82) and produced low error metrics in the test set, demonstrating the superiority of nonlinear methods in capturing complex relationships within the data. Additionally, the relatively small difference between the model’s training and test performance suggests that overfitting is not a significant risk. Variable importance analyses suggest that time and healthcare expenditure (particularly the lagged effects of these factors) are the primary determinants of life expectancy. In conclusion, despite the explanatory power of linear models, the Random Forest regression approach is superior in terms of both predictive performance and the ability to capture complex relationships.
